ResearchPod Summary
Alex: Most planners for hidden, uncertain worlds quietly assume you already know roughly how that world works. This work asks what happens if you know nothing, and only have data. Its answer is to learn a predictive model from logged experience first. Then that model drives a tree search that picks each action.
Sam: Place it for me before we go further. Whose work is it, and what kind?
Alex: It's a 2019 arXiv preprint from Yunlong Liu and Jianyang Zheng at Xiamen University. It's a method paper with a convergence proof and experiments on four standard benchmark problems.
Sam: I work next door to planning, not in it. Why should someone like me care?
Alex: Because the main alternative depends on prior knowledge that real problems rarely provide. If this holds up, you can plan under model uncertainty starting from data alone. So we'll cover what the field relied on before, the one trick that makes this work, and how far the evidence goes.
Sam: Start with the before. What did people do when they didn't trust their model?
Alex: The standard frame is a partially observable problem, meaning the agent can't see the true state, only noisy observations. The Bayesian fix puts a probability distribution over the unknown model and updates it as data arrives. The authors point out a cost: that distribution becomes part of the hidden state. The problem gets bigger than the one you started with, and exact methods only handled toy cases.
Sam: But tree search was supposed to rescue that, wasn't it?
Alex: Partly. Monte-Carlo tree search plans by simulating many possible futures from the current moment and growing a search tree from them. A Bayesian version called BA-POMCP scaled to larger problems. But in the experiments it's compared against, it was handed a lot. In Tiger, the transition model was assumed correct and the observation model nearly correct. In the network maintenance problem, the observation model was assumed known.
Sam: So "learning the model online" really meant fine-tuning a model that was almost right to begin with.
Alex: That's the authors' critique, yes. They argue that in most domains such knowledge is hard to have in advance.
Traditional approaches to planning in partially observable stochastic environments, such as POMDPs, typically rely on having access to a predefined, accurate model of the environment. While some methods attempt to learn optimal behavior under model uncertainty, they often still require significant prior knowledge or accurate initial models to converge. This paper addresses this challenge by proposing PSR-MCTS, an approach that allows an agent to plan from scratch.
Instead of latent-state representations, the authors utilize Predictive State Representations (PSRs). PSRs represent the state of a system as a vector of predictions about future observable events. This framework is naturally easier to learn and avoids the typical challenges associated with latent-state approaches. The proposed method consists of two stages: first, an offline PSR model is learned using training data, where certain reward signals are treated as observations. Second, this learned model acts as a simulator for online Monte-Carlo Tree Search (MCTS), enabling the agent to calculate optimal policies in real-time without relying on prior domain knowledge.
The authors demonstrate that their PSR-MCTS approach effectively handles planning under model uncertainty without requiring any prior information about the environment. Through both theoretical analysis and empirical testing, they show that the method is competitive with state-of-the-art Bayesian approaches, such as BA-POMCP, even when those methods are provided with nearly correct initial models. Furthermore, the approach shows excellent scalability; it was successfully applied to complex problems like the RockSample domain, where traditional BA-POMDP techniques were found to be infeasible due to the complexity of the state space.
This research provides a more practical solution for real-world applications where building an accurate model of the environment is notoriously difficult. By demonstrating that one can effectively plan from scratch using only observation-based PSRs, the paper offers a robust alternative to complex Bayesian models, which often struggle with computational intractability and dependency on expert-provided prior knowledge.

Sam: Then what replaces it? What's the one idea?
Alex: Two pieces. First, a different kind of model, called a Predictive State Representation. Instead of a hidden state you have to guess, the state is a short vector of predictions. Each entry says how likely some sequence of future observations is, given what's happened so far. You can learn it from data with a spectral method, essentially matrix decompositions of observed frequencies. No predefined hidden structure is needed, and you avoid expectation maximization and its local optima.
Sam: And the second piece?
Alex: Tree search needs to know what reward each simulated step earns. But if you never know the hidden state, you don't know the reward attached to it. So they fold certain rewards directly into the observations. Then the learned model predicts rewards the same way it predicts anything else.
Sam: Give me a concrete case, because "rewards as observations" is abstract.
Alex: Take the classic Tiger problem. There are two doors with a tiger behind one. Normally the agent just hears a noisy growl from one side. Here, the plus ten for opening the safe door and the minus one hundred for finding the tiger become extra observations. The learned model then predicts how likely each payoff is after a given action. Inside the search, sampling a payoff observation like that ends the simulated episode.
Sam: So the learned model becomes the simulator. Tree search asks it what comes next, samples an answer, updates the predictive state, and keeps going.
Alex: That's the second stage, yes. After each real action, the actual observation updates the state, and the search continues from there. Rewards that don't depend on state, like a fixed cost every step, are left out of the model.
Sam: There's a proof. What does it actually guarantee?
Alex: That the value estimates converge in probability to the optimal values, with a suitable exploration setting. The condition matters, though. It assumes infinite training data, so the learned model matches the true one. They also show that adding rewards as observations doesn't push the model's size past the number of states in the smallest equivalent hidden-state model.
Sam: Let's get to evidence. What did they test on, and against what?
Alex: Four domains. Tiger, a network administration task with three or six computers, and two RockSample grids where a robot hunts for good rocks. The baselines are BA-POMCP given no prior knowledge, and BA-POMCP given nearly correct starting models.
Sam: And the headline?
Alex: Against BA-POMCP with no prior knowledge, their method performs significantly better on Tiger and the network task. In those runs the uninformed baseline barely improved as episodes accumulated. Against BA-POMCP with nearly correct models, it's competitive. On the three-computer network task, it's close to that informed baseline. They also plotted BA-POMCP given the completely accurate model there as a reference point.
Sam: "Significantly better" from a reading of averages, or from a test?
Alex: The text reports averages over many runs, ten thousand on Tiger, and describes the gaps qualitatively. I didn't see variances or statistical tests reported. I'd treat "significantly" as their reading of the curves.
Sam: What does it cost in compute? Tree search lives or dies on time per decision.
Alex: On the small network task, it's slower. The uninformed baseline took about three hundredths of a second per action. The full method took about 0.45 seconds. A variant that keeps only observations seen in training cut that to about 0.19. But at six computers it flips. The uninformed baseline needed over four seconds per action at its lowest simulation budget, with much lower return.
Sam: Why does the Bayesian method slow down so badly?
Alex: It tracks belief with a particle filter, a cloud of sampled states. After a real observation, it has to find sampled states that would have produced exactly that observation. In bigger systems, matches get rare, so finding particles gets slow.
Sam: And RockSample is where you said BA-POMDP methods break.
Alex: Right. The paper this compares to had used a RockSample instance with only 37 states. The larger one here, five by five with seven rocks, has about 3,200. To compare at all, the baseline modeled only one action's dynamics the Bayesian way. Everything else came from a black-box simulator of the exact model. Even so, the learned-model approach scored higher, with no prior knowledge.
Sam: Was it faster there too?
Alex: No. On the smaller grid it took about 0.93 seconds per action, versus about 0.16 for the baseline. On the larger grid they were roughly even. The authors attribute the baseline's speed to that black-box shortcut.
Sam: Here's my objection. "From scratch" sounds strong. Somebody chose which rewards count as observations, and somebody collected the training data.
Alex: That's fair. The designers picked which rewards to fold in, and they set the model's size by hand for the larger domains. Building the training data meant running each test sequence fifty times, which assumes you can replay actions repeatedly. The model is learned once, offline, and isn't updated during execution. The authors name online updating as future work. So "no prior knowledge" here means no prior model, not no design choices.
Sam: Given all that, who should read the full paper, and where should they start?
Alex: Anyone working on planning under partial observability, or model learning when the model is uncertain. Start with the Plan from Scratch subsection and its four short algorithms. That's where the reward-as-observation trick lives. Then read the Evaluated methods paragraph, which spells out exactly what prior knowledge each baseline received. It changes how you read every comparison.
Sam: And for everyone else, the one line to keep?
Alex: If you can't trust your model, learn one that predicts what you'll see, rewards included. Then let tree search use it as the simulator.
Sam: A useful reminder of what "from scratch" can and can't mean.
